(1) 光伏阵列故障表征参数的选取与数据采集平台构建
光伏阵列在实际运行过程中会受到多种因素的影响而产生不同类型的故障,包括电池片老化导致的性能衰减、局部遮挡引起的热斑效应、接线盒虚接造成的串联电阻增大以及旁路二极管失效等典型故障模式。为了实现对这些故障状态的准确诊断,首先需要确定能够有效反映光伏阵列工作状态的特征参数。传统的故障诊断方法往往需要采集大量的中间过程参数,这不仅增加了监测系统的复杂度和成本,而且某些参数的获取需要专业级的测试设备难以在实际电站中大规模部署。本研究通过对光伏电池的物理特性和故障机理进行深入分析,筛选出六个既容易获取又能够有效表征常见故障的关键参数作为诊断依据。开路电压和短路电流分别反映了光伏阵列在两个极端工作点的电气特性,当电池片发生串联电阻增大或并联电阻减小等故障时这两个参数会出现明显的偏移。最大功率点电压和最大功率点电流则描述了光伏阵列在最佳工作状态下的输出能力,局部遮挡或热斑故障会导致最大功率点的位置和数值发生改变。填充因子作为一个综合性指标反映了光伏电池将光能转化为电能的效率,其数值下降通常意味着电池内部存在某种形式的损耗增加。考虑到光伏阵列的输出特性受环境因素特别是太阳辐照强度的显著影响,将辐照度作为第六个表征参数纳入诊断模型,以便区分由环境变化引起的正常输出波动和由故障导致的异常输出偏差。基于上述参数选择原则,搭建了能够模拟七种典型故障状态和正常工作状态的光伏阵列数据采集平台,为后续的小样本故障诊断研究提供实验数据支撑。
(2) 基于生成单边对抗网络的小样本数据增强与故障诊断方法
在实际光伏电站的运维过程中,由于故障发生的随机性和稀缺性,某些类型的故障样本积累数量往往十分有限,这种小样本条件对基于深度学习的故障诊断方法形成了严峻挑战。当训练样本数量不足时,深度神经网络容易出现过拟合现象,即模型在训练集上表现良好但在新样本上的泛化能力严重下降。针对这一问题,本研究首先尝试了两种经典的小样本学习方法:孪生网络通过学习样本对之间的相似性度量来进行分类决策,可以在少量标注样本的情况下实现较好的识别效果;基于变换网络的时间序列生成对抗网络则试图通过生成合成样本来扩充训练数据集。实验结果表明这两种方法虽然都能在一定程度上缓解小样本问题,但各自存在明显的局限性。孪生网络在推理阶段需要将待测样本与支持集中的每个样本逐一比对计算相似度,导致诊断速度大幅下降难以满足在线监测的实时性要求。传统的生成对抗网络在小样本条件下训练稳定性较差,生成样本的质量和多样性难以保证,有时反而会因为引入低质量的合成数据而降低诊断模型的性能。为了克服上述缺陷,本研究提出了一种将生成对抗学习与度量学习相结合的生成单边对抗网络架构。该网络使用预训练的孪生网络替代传统生成对抗网络中的判别器,孪生网络通过对比真实样本对和生成样本与真实样本配对的相似度差异来指导生成器的优化方向。同时引入多核最大均值差异作为辅助损失项,从数据分布的角度约束生成样本与真实样本之间的统计特性一致性。这种设计使得生成器在训练过程中能够获得更加稳定和有意义的梯度反馈,从而生成出既与真实故障样本高度相似又保持足够多样性的合成数据。
(3) 生成样本质量评估与故障诊断系统的工程化实现
生成对抗网络的训练过程缺乏直观的收敛指标,如何评估生成器产生的合成样本是否达到可用于训练故障诊断模型的质量标准是一个需要解决的关键问题。传统的评估指标如弗雷歇初始距离主要用于图像生成任务,对于光伏阵列故障特征这类低维时序数据的适用性有限。本研究根据生成单边对抗网络的设计原理提出了一种新的评估指标,该指标从两个互补的角度衡量生成样本的质量:一方面计算生成样本与同类别真实样本之间的相似度确保标签一致性,另一方面评估不同生成样本之间的差异程度保证数据多样性。只有当生成样本同时满足与真实样本足够相似且彼此之间存在合理差异这两个条件时,才能认为生成器已经学习到了真实故障数据的内在分布规律而非简单地记忆和复制训练样本。通过该指标的监控可以确定生成器训练的最佳停止时机,避免训练不足导致的生成质量低下或训练过度导致的模式崩塌问题。在完成核心算法的开发验证后,本研究进一步将整套小样本故障诊断方法封装为一个完整的软件系统。该系统采用模块化的架构设计,将数据预处理、样本生成、模型训练和故障诊断等功能划分为相互独立的子系统,各子系统之间通过标准化的数据接口进行通信,便于后续的功能扩展和维护升级。
